LLM Context Window Management: RAG vs. Long Context vs. Memory Architectures
The Hook
You’re building an LLM app. Context window: 128K tokens. You stuff the whole codebase in. The model hallucinates, misses the middle, costs $2/query. Context windows don’t scale. The solution isn’t bigger windows—it’s memory architecture.
The Thesis
Context windows are working memory (RAM); agent memory needs persistent storage (disk) with retrieval. Three approaches compete: RAG (retrieval-augmented generation), long-context models, and memory architectures (MemGPT, MemWalker, MemoryBank). Each has distinct trade-offs for latency, cost, precision, and consistency.
The Science
The Three Architectures
| Approach | Mechanism | Context Limit | Cost/Query | Precision | Consistency |
|---|---|---|---|---|---|
| Long Context | Stuff everything in prompt | Model limit (128K-1M) | High ($/token) | Low (lost in middle) | None |
| RAG | Embed → retrieve → inject | Unlimited | Medium | Medium (retrieval noise) | Eventual |
| Memory Architecture | External DB + router | Unlimited | Low | High (targeted) | Strong (ACID possible) |
The “Lost in the Middle” Problem
Liu et al. (2023, Lost in the Middle): Models attend to start/end of context; middle tokens ignored. At 100K tokens, middle-token retrieval accuracy drops >50%.
Implication: Stuffing 100K tokens ≠ 100K tokens of usable context.
RAG Limitations
| Problem | Cause | Mitigation |
|---|---|---|
| Retrieval noise | Embedding similarity ≠ relevance | Hybrid search (BM25 + vector) |
| Chunking artifacts | Fixed-size chunks break context | Semantic chunking + overlap |
| No multi-hop reasoning | Single retrieval pass | Iterative retrieval / agentic RAG |
| Stale data | Index lag | Incremental indexing + TTL |
Memory Architecture (MemGPT, MemWalker, MemoryBank)
Core idea: Treat context as cache; externalize memory to vector store + knowledge graph + episodic log.
MemGPT (Packer et al., 2023):
- Main context (working memory) + external memory (disk)
- Page in/out via function calls
- Self-editing memory via reflection
MemWalker (2024):
- Tree-structured memory
- Walk memory tree for multi-hop reasoning
- Compress leaf nodes → summaries
MemoryBank (Wang et al., 2023):
- Key-value memory with importance scoring
- Forgetting curve for irrelevant memories
The Decision Framework
| Requirement | Choose |
|---|---|
| Simple Q&A, static docs, <10K docs | RAG (LangChain/LlamaIndex + Qdrant) |
| Multi-hop reasoning, evolving knowledge | Memory Architecture (MemGPT + Qdrant + KG) |
| Single document analysis, one-off | Long Context (if <50K tokens) |
| High throughput, low latency | RAG + caching |
| Consistency critical (finance, legal) | Memory Architecture + ACID DB |
| Rapid prototyping | RAG (LangChain) |
| Production, long-running agents | Memory Architecture |
The Protocol: Build Your Memory Stack
Level 1: RAG Baseline (Week 1)
# Minimal RAG
from qdrant_client import QdrantClient
from sentence_transformers import SentenceTransformer
encoder = SentenceTransformer("BAAI/bge-m3")
client = QdrantClient("localhost")
def add_doc(text, metadata):
client.upsert("docs", points=[{
"id": uuid4(),
"vector": encoder.encode(text).tolist(),
"payload": {"text": text, **metadata}
}])
def query(q, top_k=5):
return client.search("docs", encoder.encode(q).tolist(), limit=top_k)
Level 2: Agentic RAG (Week 2)
- Add query rewriting (hyde, step-back prompting)
- Add re-ranker (cross-encoder)
- Add citation enforcement
Level 3: Memory Architecture (Week 3-4)
# Memory router
def retrieve_memory(query: str, context: dict) -> str:
# 1. Semantic search
vector_results = vector_store.search(query, top_k=5)
# 2. Graph traversal for entities
entities = extract_entities(query)
graph_results = kg.traverse(entities, max_hops=2)
# 3. Recent episodic context
recent = episodic.get_recent(turns=5)
# 4. Fuse & rerank
fused = rerank(vector_results + graph_results + recent, query)
return format_for_context(fused, token_budget=8000)
The Counterpoint
- RAG is simpler: 100 lines vs. 1000 lines
- Long context improving: Gemini 1.5M, Claude 200K, improving “middle” attention
- Cost: Memory architecture adds 50-200ms latency
- Overkill: Simple chatbots don’t need MemGPT
Practical Takeaway
Start with RAG (Qdrant + BGE-M3 + cross-encoder re-ranker). Measure retrieval precision. If <80% or you need multi-hop reasoning → add knowledge graph + episodic log. The architecture should match the problem, not the hype.
